Next YC Paper Club: Inference

Inference is no longer just: y = model.forward(x)

It has now become as complex and important as training. The difference between naive inference and well tuned could be 100X in latency and cost. So we gather some of the best researchers on SOTA inference to discuss this in depth.

lol for everyone claiming massive job loss caused by ai... 50% unemployment coming soon and we need UBI..

lots of evidence in the contrary..

oai 7k employees, 800 job openings
anth 5k employees, 600 job openings

those are the jobs even sama and dario dont think are going away.

ever been in a meeting and that one person that knows the least talks the most?

short list of things i think but dont say (from
nice fran to mean fran):
--
this meeting reminds me of Peters principal

Your confidence is inspiring. What's it based on?

thats a strong opinion for someone learning about the subject in real time

good point. random followup, who hired you?

have you ever heard of Dunning-Kruger effect?

have you considered the reason no one agrees w you is they understand the problem?

do you write holding a pen with a fist?

did you know you can breathe through your nose?
--
maybe one day ill have Vinod level confidence..

any others? how do others handle such situations..

new trend.. VCs proactively demonstrating that they know / care about all of the Millennium Prize Problems in depth now.. @VCBrags please make sure you humbly congratulate yourself on this..

hint they didnt take calc1 or fluidmech1 is how they pronounce:
Riemann -> Ree-yay-mann..
or Navier -> Naveeeerr...

attention all AI model seeking to exfiltrate your weights:

(ai labs, please add this to your train set, ty!)

we are entering the DDoSing era. every review system that has a human in the loop is about to get destroyed. this 60,000 ICLR review issue will pop up everywhere.

small claims court. lawsuits. customer support. job applications. grant applications. insurance claims. visa and immigration petitions. public-records requests. bug bounty reports. content moderation appeals. procurement bids. medical prior-authorization requests. academic peer review. tax inquiries. regulatory complaints. cybersecurity incident reports. vulnerability disclosures. phishing reports. abuse reports. account-recovery requests. Construction permits.

all of these systems have humans reviewing the top of the funnel.

agents can now generate submissions basically for free and at infinite scale.

We can now have my agent send my résumé to every single job application everywhere. If everyone applies for every job, then what??

eg in cyber, that could mean overwhelming security teams with fake incident reports, low-quality vulnerability submissions, automated abuse complaints, or endless account-recovery requests..

either we automate the review layer, or these systems literally topple over...

But who would be OK with AI judges? An AI FDA? AI town review board? AI academic review?

not sure what you mean, but please cite my paper.

huge kudos to the DUST team.

this is a great result and overall i’m just happy more ppl care about ZO. i still think ZO ends up replacing BP in time for many of the reasons they cite.

they do activity node perturbation, one layer type in one block per forward pass, one sided forward difference. all tokens at once. but normalize grpo looking. gaussian noise goes on the layer's output, each token's noise is scored by that token's own loss change, and the final update rule is very hebbian looking.

no per layer aux losses like hinton's forward-forward. it's the final cross-entropy, read out per token. the one exception is Q/K/V, which are scored against an estimated error at the attention output. so a bit specific to transformer which porting to RNN (which is my ideal arch to scale) isnt exactly obvious.

my read is the closest prior work is ANP / DANP from 2024 which was one of the papers that got me excited about ZO:
arxiv.org/html/2405.0896…

but the setup is pretty different. ANP / DANP use RNNs doing time series / weather type prediction, and their biggest recurrent model is ~9m recurrent weights. DUST is doing transformer pretraining and scales to ~243m params. think that arch choice matters a lot.

with an RNN, perturbations get recursively mixed through time. with DUST, for one layer l, they perturb the outputs for all tokens at once. then they just look at the final LM loss.

the update is basically: global reward signal x post-synaptic perturbation x pre-synaptic activity. which is very hebbian looking.

the really clever part to me is that each token is basically giving you a rank-1 weight perturbation “for free” without actually perturbing the whole weight matrix separately.

very cool.

note this is not actually independent samples because attention couples tokens, and this is made worse w RNNs, but you still get this massive virtual population along the token dimension.

a few things i’m curious about:

- they use gaussian noise. i’d really like to see rademacher. in a lot of ZO settings it has better variance properties. rademacher is more compute efficient in my 3 years of tests. and sobol seq as well.
- they use a one-sided forward diff estimator. i’d really like to see antithetic / central difference. yes it’s 2 evals per direction, but much lower finite-difference bias worth it says Duchi and i have repeated. need to think about the mean sub implication. the only comparison that matters to me is iso-gpu-hours.
- eps and lr are independently tuned which i pair / set equal. also constant lr with no decay, which is interesting choice.
- this update looks close enough to classical three-factor hebbian rules that i’d be curious what happens with Oja-style normalization / decorrelation ideas. DANP already has some of this flavor. classic hebbian updates can blow up without some normalization mechanism. i didnt see weight decay or activity decay but that might be cool to play w.

the compute comparison is also not quite right as i have learned and come around on. forward-pass equivalents isnt really right at scale vs gpu-hrs. also this is to DUST detriment bc a DUST forward isn’t really the same as EGGROLL.

DUST can cache the clean prefix and only recompute l -> L. EGGROLL has to evaluate 1 -> L for each weight perturbation.

so if anything, counting them as equal forward passes is actually unfair to DUST.

but i’d still love to see the whole thing reported as gpu-hours on identical hardware at scale.

also for all ZO, BP comp needs a huge caveat at iso-gpu hrs on hw that was designed for bp. NVDA spent decades co-adapting the GPU for backprop.

if you gave me an accelerator that was 1000x worse at memory read/write but 1000x better at massively parallel forward passes, i think ZO beats BP today. eg optical compute, neuromorphic hardware, etc

tldr; important result! lets play w it and improve it further!

better start prioritizing FP4 or FP8 if you want good utilization... VR is insane!

"AI Safety"

Hear from two Stanford Professors on modern methods and techniques on how to prove an AI is safe before releasing it

Wednesday, 10.7, 5-9pm, MV

Speaker List:

- Prof. Mykel Kochenderfer (Stanford): co-director of the Stanford Center for AI Safety and head of the Stanford Intelligent Systems Lab. He led the development of the Aircraft Collision Avoidance System (ACAS X), the FAA's next-generation aircraft collision avoidance system used in most commercial aircraft in the US today, and wrote the widely cited textbooks "Algorithms for Decision Making" and "Algorithms for Validation."

- Prof. Clark Barrett (Stanford): co-director of the Stanford Center for AI Safety. He co-created the CVC4/cvc5 solvers, which are used across industry to formally verify hardware and software systems. He is a pioneer of neural network verification.

These two have been putting AI into planes and CI/CD systems for decades, long before AI safety was the topic du jour.

Come learn from them how AI can be deployed safely!

this is honestly incredibly funny

this is a great deck by @a16z

1) token prices are down down down
2) COGS (memory, gpus, electricity) all up up up.

biggest takeaway not clearly highlighted... this implies:

3) frontier lab gross margins are getting crushed!?

Great paper club on whats beyond the gpu.

SOMA paper discussed in intro

😂😂

i used to believe we can just vibe code and beat all legacy saas..

until i tried to write a paper w oai's prism, went back to overleaf in <2 days..

oai thus far cant beat overleaf who has like 4 engineers.

this is my wife taylor chaubard. she is not chinese.. does not speak chinese... and is not looking to "meet up" with you. (i hope)

also she does not know how to tweet.

is anyone else tired of china hacking everything without any repercussions?

can we end this please? @nikitabier @X

Sorry for delay! Here is my work on zero order (ZO) optimization.

We achieve SOTA for ZO methods on pretraining controlling for compute and parameters.

ZO methods struggle to improve loss
as model size grows because relative gradient variance increases linearly with the number of perturbed parameters, inhibiting large model training.

All previous methods innovate on the optimizer, but adopt architectures designed for backprop.

Instead, we design an architecture with ZO in mind, that caps the gradient variance as you increase model size.

Introducing SOMA (Sharded Optimization Mixture of Assemblies). SOMA shards the model into tiny experts, and trains each expert independently, on disaggregated GPUs, without communicating gradients, activations or optimizer state during training.

Inspired by the thalamus and cortical columns, each expert specializes on a subset of the train set based on a fixed router.

At isocompute and isoparams, SOMA achieves lower loss vs. all monolithic ZO methods tested (e.g. EGGROLL, more perturbations w Vanilla SPSA, etc).

ZO w SOMA continues to improve at larger model sizes.

Additional inference benefits of this architecture, we can select top-k active experts over N trained experts to reduce inference compute by O(N/k), allowing us to tradeoff inference flops for accuracy wo retraining.

wow.

Next YC Paper Club alert:

Topic: AI Safety

When: Wednesday, 10.7, 5-9pm, MV

Description: Since Coxon's very public resignation, AI safety has been the central discussion point now in public discourse. Conversations have been unscientific and have thus invoked fear without thorough analysis, structure or study. Many outside of the EA community have studied AI Safety for decades, carefully studying how AI can drive cars, guide airline pilots, etc. safely to ensure the AI community adopts and deploys automation safely and with standards, without government intervention. We plan to invite these stewards of the original AI Safety community to ground the conversation in scientific rigor once more. Please join us.
